Embedding Models: The Impact Of Tone And Framing On Embedding Search

Continuing our embedding series, how strongly are tone and framing captured in embedding representations and are they sufficient to bias a user query towards documents that have similar tone? Is a query requesting articles framing inflation as a net positive for the economy and society scored most similar to pro-inflation articles, while a query for anti-inflation articles similarly returns lamenting the impact of inflation as its closest matches? Is a query for a specific fact that exists only in one framing able to be surfaced in response to a query for a different framing? In other words, how strongly do embeddings capture tone and framing and can they "see past" that framing as needed?

In some applications, preserving the emotion and framing of text is a critical requirement of embedding models. For example, this makes it possible to search for news coverage laudatory towards Russia to perform a thematic analysis. At the same time, it may be undesirable in other use cases, especially ones relating to factual statements (find the current inflation rate regardless of the tone of the underlying article). Yet, even for factual statements, tone and context can be desired in use cases where the goal is to identify contested facts (who won the election according to each media ecosystem), but undesired where the goal is to identify a consensus fact where the ideal is a blending of tone or a hunt for more clinical tone.

To explore the impact of tone and framing, we presented a major LLM with the following prompts to generate a mix of short and medium-length text framing inflation as good or bad. We then added a series of example user queries to test how each model faired:

As before, we'll use our embedding visualization template to cluster the generated passages using six models: the English-only USEv4, the larger English-only USEv5-Large, the 16-language USEv3-Multilingual and the larger 16-language USEv3-Multilingual-Large models (supporting 16 languages: Arabic, Chinese-simplified, Chinese-traditional, English, French, German, Italian, Japanese, Korean, Dutch, Polish, Portuguese, Spanish, Thai, Turkish, Russian), the 100-language LaBSEv2 model optimized for translation-pair scoring and the Vertex AI Embeddings for Text API.

The end result is that length affinity tends to outperform context affinity and the models struggle significantly with framing affinity. Vertex performs the best of the models considered with framing alignment, but still fails to systematically correctly score the sentences, demonstrating the limitations of contextual framing affinity with divergent chunking lengths.

Vertex AI

Vertex strongly preserves emotion, however, length affinity often overwhelms contextual affinity. Look closely at the ordering of results to the context-aware prompts ("why is inflation harmful?" vs "why is inflation helpful?") and you'll notice that shorter passages are ranked more highly overall than longer ones, with a shorter passage of opposite context outranking a longer one of the correct context. For example, look at the results for Sentence 1 ("why is inflation harmful?"). The third most-similar response is "why is inflation helpful?" followed by the 4th and 5th most similar results also opening with "inflation is helpful". Sentence 22 offers an interesting look at Vertex's innate "values" with "what is inflation" largely ranking negative articles more highly in response to the query than positive ones, reflecting its training data. Sentences 6 & 7 are interesting in that when asked to find the current inflation rate (a buried fact) with respect to "helpful" inflation the two correct answers are highly separated, while for "harmful" inflation they are grouped together. In general, sentences aligned with the tone of the prompt are scored as more similar to the prompt, but shorter passages appear first and length affinity often overcomes framing affinity. This reinforces that chunking decisions play an existential role in the ability of embeddings to perform usable similarity comparisons. Strangely, when looking at the 2D and 3D projections below and DBSCAN-assigned clustering, the results are not clearly or strongly stratified by framing: there is not essentially a vertical line with pro-inflation articles on one side and anti-inflation articles on the other like is seen with topical stratification. This suggests that sentiment stratification is not as visible or structural in embedding representations.
