Story Segmentation Of TV News: Impact Of Input Chunking On Segmentation Results

Segmenting television news broadcasts into their underlying stories has the added complexity of needing to transparently pass timecode information through the clustering process: we need to know the start/stop times of all the clips that make up a story. Unlike a text document that can simply be clustered into stories using a single block of text, broadcasts must record the start/stop timestamps of each segment making up that story, meaning they must be prepared for clustering in a way that preserves this information, rather than simply distilled down into a monolithic text blob. Put more simply: just having a list of the stories that appear in a 6-hour broadcast isn't very helpful without the timecode information that shows where in that broadcast the story appears.

We've tried myriad approaches to this challenge, finding that breaking broadcasts into bite-sized chunks and asking Gemini to break the broadcast into stories and determine which story each chunk belongs to achieves the best results. The inverse, asking Gemini to annotate the text directly, yields subpar results, vastly increases the output token requirements (increasing cost and decreasing the processable text length due to 65K output + thinking token limits) and is highly unstable since LLMs can still "correct" input text even when prompted not to, meaning it can be extremely difficult to line up the altered output text against the input text to restore timecodes. Worse, whether human typed or machine ASR'd, captioning tends to emphasize an infinite stream of words with highly irregular and undependable punctuation, meaning splitting it into "sentences" can yield paragraph and even page-long chunks of text.

To date, we've chunked broadcasts using their closed captioning-native line breaks (breaking it into chunks exactly as its captioning is broken up), but would using longer chunks improve story segmentation? Here we compare captioning-native, 2, 4, 8 and 12 second and sentence-level chunking on two sample broadcasts: an hour-long personality-driven show and a 30-minute evening news broadcast. Longer input chunks had minimal impact on the evening broadcast, likely due to its existing sharp topical divides. The hour-long broadcast yielded the same core stories across all chunking levels, but the coarsest chunking levels often yielded additional subdivisions of those stories into their substories. However, larger chunks yielded highly unstable results, with runs varying dramatically in their story segmentation, whereas segmentation was far more consistent with fewer chunks.

These results suggest that the best tradeoff appears to be to utilize native line breaks for hand captioned broadcasts (roughly equal to 2 seconds per chunk) and a similar 2-second aggregation for ASR'd broadcasts.

Let's start with an hour-long personality-driven show from last month, comparing several different segmentation strategies:
